When a back button is used on a page break -- all forms are adding a Back button below the Submit button and it can't be deleted.

That is a default behavior, but you can always hide both Next and Back Buttons by clicking on them and choosing their hide options like so:
Once you do that, the back button will no longer be shown to you as shown above.

The problem I'm having -- and this may be user error -- is illustrated below. There is no Back Button to hide in edit mode (see below), but when I preview or go to the live form there is a Back Button (click here and go to the last page) below the Submit -- Clear Form buttons.

Simply click on any of the Page Break fields(Back&Next field) then click on the Back Visibility button, and set it as Hidden:
